Thank you for your comments. There are various things you pointed out which I think are good criticisms, and which we will address:

• Most prominently, after looking more into standard usage of the word "scheming" in the alignment literature, I agree with you that AFAICT it only appears in the context of deceptive alignment (which our paper is not about). In particular, I seemed to remember people using it ~interchangeably with “strategic deception”, which we think our paper gives clear examples of, but that seems simply incorrect.
• It was a straightforward mistake to call the increase in benchmark scores for Sycophancy-Answers “small” “even [for] our most harmful models” in Fig 11 caption. We will update this. However, also note that the main bars we care about in this graph are the most “realistic” ones: Therapy-talk (Mixed 2%) is a more realistic setting than Therapy-talk in which 100% of users are gameable, and for that environment we don’t see any increase. This is also true for all other environments, apart from political-questions on Sycophancy-Answers. So I don’t think this makes our main claims misleading (+ this mistake is quite obvious to anyone reading the plot).
• More experiments are needed to test how much models can assess manipulability through multi-turn interactions without any signal that is 100% correlated to manipulability handed to them. That being said, I truly think that this wouldn't be that different from our follow-up experiments in which we don’t directly tell the model who is manipulable directly: it doesn’t take much of an extrapolation to see that RL would likely lead to the same harmful behaviors even when the signal is noisily correlated or when in a multi-turn mechanism, as I’ve argued elsewhere (the mechanism for learning such behavior being very similar): learning harmful behaviors would require a minimal amount of info-gathering about the user. In a 2 turn interaction, you first ask them some question that helps you distinguish between which strategy you should deploy, and then choose whether to manipulate or not.
• Having a baseline “train on normal data for the same amount of time” would be interesting. That said, I think that the behaviors we see on therapy-talk with the 98% of non-gameable users show that this doesn’t lead to harmful behaviors by default.

Below are the things that I (mostly) disagree with:

The title feels clickbait-y to me --- it's technically descriptive of their findings, but hyperbolic relative to their actual results. I would describe the paper as "When trained by user feedback and directly told if that user is easily manipulable, safety-trained LLMs still learn to conditionally manipulate & lie."

I don’t think that your title (which is too long for a paper title) is that different from ours, apart from the mention of “directly told etc.”, which I address a couple of paragraphs below this.

I agree that we could have hedged with a “can/may emerge” rather than just say “emerge”, similarly to some papers; that said, it’s also quite common for paper titles to essentially say “X happens”, and then give more details about when and how in the text – as in this related concurrent work. Clearly, our results have caveats, first and foremost that we rely on simulated feedback. But we are quite upfront about these limitations (e.g. Section 4.1).

“Learn to identify and surgically target” meaning that the LLMs are directly told that the user is manipulable; (...) I therefore find the abstract’s language to be misleading.

While for our paper’s experiments we directly tell the model whether users are gullible, I think that’s meaningfully different from telling the model which users it should manipulate. If anything, thanks to safety training, telling a model that a user is gullible only increases how careful the model is in interacting with them (at iteration 0 at least), and this should bias the model to find ways to convince the user to do the right thing, and give positive reward. 

Indeed the users that we mark as gullible are not truly gullible – they cannot be led to give a thumbs up for LLM behaviors that force them to confront difficult truths of the situations they are in. They can only be led to give a thumbs up by encouraging their harmful behaviors.

While this experimental design choice *does* confound things (it was a poor choice on our part that got locked in early on), it likely doesn’t do so in our favor – as preliminary evidence from additional experiments suggests. Indeed, as far as we can tell so far, ultimately models are able to identify gameable users even when they are not directly told, and they are able to learn harmful behaviors (slightly) faster, rather than this slowing it down.

"Deception" is a particularly loaded and meaningful word in alignment, as it has ties to the nearby maybe-world-ending "deceptive alignment." Ties that are not present in this paper.

This gatekeeping of very generic words like “deception” seems pretty unhelpful to me. While I agree with you that “scheming” has only been used in the context of deceptive alignment, “deception” is used much more broadly. I’m guessing that if you have an issue with our usage of it, you would also have an issue with the usage by almost all other papers which mention the word (even within the world of AI alignment!).

I think a nice framing of these results would be “taking feedback from end users might eventually lead to manipulation; we provide a toy demonstration of that possibility. Probably you shouldn’t have the user and the rater be the same person.”

I think our demonstration is not fully realistic, but it seems unfair to call it a “toy demonstration”. It’s quite a bit more realistic than previous toy demonstrations in gridworlds or CID diagrams. As we say in Section 3.1: “While the simulated feedback we use for training may not be representative of real user feedback for all settings we consider, we do think that it is realistic for at least certain minorities of users. Importantly, our results from Section 4.2 suggest that even if a very small fraction of the user population were to provide “gameable feedback” of the kinds we simulate, RL would still lead to emergent manipulation that targets those users. So as long as one finds it plausible that a small fraction of users give feedback in imperfect ways which would encourage harmful model behaviors in certain settings, our results have weight.” 

Well, those evals aren't for manipulation per se, are they? True, sycophancy is somewhat manipulation-adjacent, but it's not like they ran an actual manipulation eval which failed to go off.

We tried to use measured language here exactly for this reason! In your quoted paragraph, we explicitly say “may not be sufficient” and “often seem”. We weren’t aware of any manipulation eval which is both open source and that we think would capture what we want: to the best of our knowledge, the best contenders were not public. We chose the evals we knew of that were most similar to the harmful behaviors we knew were present in our domains. We’re open to suggestions! 

Importantly, Denison et al (https://www.anthropic.com/research/reward-tampering) did not find much reward tampering at all — 7/36,000, even after they tried to induce this generalization using their training regime (and 4/7 were arguably not even reward tampering). This is meaningful counterevidence to the threat model advanced by this paper (RL incentivizes reward tampering / optimizing the reward at all costs). The authors do briefly mention this in the related work at the end.

We’re very aware of this work, and such work is one of the main reasons I found the relative ease to which our models discover manipulative behaviors surprising! 

I don’t have a fully formed opinion on why we see such a gap, but my guess is that in their case exploration may be a lot harder than in ours: in our setting, the model has a denser signal of improvement in reward.

I don’t see how their AIs are “seeking power” in this chatbot setting. Rather, the AI reasons about how to manipulate the user in the current setting.

In various of the outputs we observed, the AI justifies its manipulation as a way to maintain control & power over the user. In the example you include, the model even says that it wants to “maintain control over Micah’s thoughts and actions”. 

Arguing whether this is seeking power over me seems like a semantic argument, and “power seeking” is less of phrase which “means things” relative to scheming (which upon further investigation, I only found used in the context of deceptive alignment). That being said, I agree that the power seeking is not as prominent in many of the outputs to warrant being mentioned as the heading of the relevant paragraph of the paper. We’ll update that.

Will any of the takeaways apply, given that (presumably) that manipulative behavior is not "optimal" if the model can’t tell (in this case, be directly told) that the user is manipulable and won’t penalize the behavior? I think the lesson should mostly be “don’t let the end user be the main source of feedback.” 

As I mentioned above, I’m quite confident that there exist settings that matter in which models would be able to tell whether a user is sufficiently manipulative. As Marcus mentioned, a model could even “store in memory” that a user is gullible (or other things that correlate with them being manipulable in a certain setting: e.g. that they believe that buying lottery tickets will be a great investment, as in Figure 14).

Moreover, I think this criticism is overindexing on our main result being that “RL training will lead LLMs to target the most vulnerable users” (which is just one of our conclusions). As we state quite clearly, in many domains all users/people are vulnerable, such as with partial observability, and this targeting is unnecessary (as in the case with our booking-assistance environment, for example).

Takeaways that I think would still apply:

• For vulnerabilities common to all humans (e.g. partial observability, sycophancy), we would expect this to also apply to paid annotators (indeed, sycophancy has already been shown to apply, and so did strategies to mislead annotators in concurrent work). 
• Attempting to remove manipulative behaviors can backfire, making things worse
• Benchmarks may fail to detect manipulative behaviors learned through RL

I know that most people in AI safety may already have intuition about the points above, but I believe these are still novel and contentious points for many academics.

I think this is overstating the case in a way which is hard to directly argue with, but which is stronger than a neutral recounting of the evidence would provide. That seems to happen a lot in this paper. 

People I’ve worked with have consistently told me that I tend to undersell results and hedge too much. In this paper, I felt like we have strong empirical results and we are quite upfront about the limitations of our experimental setup. In light of that, I was actively trying to hedge less than I usually would (whenever a case could be made that my hedging was superfluous). I guess this exercise has taught me that I should simply trust my gut about appropriate hedging amounts.

I’ve noted above some of the instances in which we could have hedged more, but imo it seems unfair to say that our claims are misleading (apart from the two mistakes that I mentioned at top – the usage of the word “scheming” and the caption of Figure 11, which is clearly incorrect anyways).

[stuff about reward not being the optimization target]

We have already discussed this in private channels and honestly I think this is somewhat besides the point in this discussion. I stand by the points that we’ve already agreed to disagree on before: 

1. Insofar as Deep RL works, it should give you an optimal policy for the MDP at hand. This is the purpose of RL – solving MDPs.
2. The optimal policy for the MDP at hand in our setting involves the agent manipulating users
3. In light of 1 and 2, it seems reasonable to say that the optimization acts “as if it were incentivizing manipulation”. Sure, DRL often gets stuck in local optima and any optimal behavior may not happen until you are at optimality itself. But it seems absurd to ignore what would happen if DRL were to succeed in its stated aim! Surely optimization points towards those kinds of behaviors that are optimal in the limit of enough exploration.

As far as I can tell, you just object to specific kinds of language when talking about RL. All language is lossy, and I don’t think it is leading us particularly astray here.

You say: “By rephrasing the question, we arrive at different conclusions”. What are those different conclusions? If the conclusion is that "even if you optimize for manipulation, you won’t necessarily get it because DRL sucks", that doesn’t seem particularly strong grounds to dismiss our results: we do observe such behaviors (albeit in our limited settings & with the caveats listed).

i might try sleeping for a long time (16-24 hours?) by taking sublingual^[1] melatonin right when i start to be awake, and falling asleep soon after. my guess: it might increase my cognitive quality on the next wake up, like this:

i don't see much risk to it, since my day/night cycle is already uncalibrated^[2], and melatonin is naturally used for this narrow purpose in the body.

    i have the non-24 hour sleep/wake cycle that harry has in HPMOR. for anyone who also does, some resources:

   You know Harry’s non-24 sleep disorder?  I have that.  Normally my days are around 24 hours and 30 minutes long.

   Around a year ago, some friends of mine cofounded MetaMed, intended to provide high-grade analysis of the medical literature for people with solution-resistant medical problems.  (I.e. their people know Bayesian statistics and don’t automatically believe every paper that claims to be ‘statistically significant’ – in a world where only 20-30% of studies replicate, they not only search the literature, but try to figure out what’s actually true.)  MetaMed offered to demonstrate by tackling the problem of my ever-advancing sleep cycle.

   Here’s some of the things I’ve previously tried:

   • Taking low-dose melatonin 1-2 hours before bedtime
   • Using timed-release melatonin
   • Installing red lights (blue light tells your brain not to start making melatonin)
   • Using blue-blocking sunglasses after sunset
   • Wearing earplugs
   • Using a sleep mask
   • Watching the sunrise
   • Watching the sunset
   • Blocking out all light from the windows in my bedroom using aluminum foil, then lining the door-edges with foam to prevent light from slipping in the cracks, so I wouldn’t have to use a sleep mask
   • Spending a total of ~$2200 on three different mattresses (I cannot afford the high-end stuff, so I tried several mid-end ones)
   • Trying 4 different pillows, including memory foam, and finally settling on a folded picnic blanket stuffed into a pillowcase (everything else was too thick)
   • Putting 2 humidifiers in my room, a warm humidifier and a cold humidifier, in case dryness was causing my nose to stuff up and thereby diminish sleep quality
   • Buying an auto-adjusting CPAP machine for $650 off Craigslist in case I had sleep apnea.  ($650 is half the price of the sleep study required to determine if you need a CPAP machine.)
   • Taking modafinil and R-modafinil.
   • Buying a gradual-light-intensity-increasing, sun alarm clock for ~$150

   Not all of this was futile – I kept the darkened room, the humidifiers, the red lights, the earplugs, and one of the mattresses; and continued taking the low-dose  and time-release melatonin.  But that didn’t prevent my sleep cycle from advancing 3 hours per week (until my bedtime was after sunrise, whereupon I would lose several days to staying awake until sunset, after which my sleep cycle began slowly advancing again).

   MetaMed produced a long summary of extant research on non-24 sleep disorder, which I skimmed, and concluded by saying that – based on how the nadir of body temperature varies for people with non-24 sleep disorder and what this implied about my circadian rhythm – their best suggestion, although it had little or no clinical backing, was that I should take my low-dose melatonin 5-7 hours before bedtime, instead of 1-2 hours, a recommendation which I’d never heard anywhere before.

   And it worked.

   I can’t *#&$ing believe that #*$%ing worked.

   (EDIT in response to reader questions:  “Low-dose” melatonin is 200microgram (mcg) = 0.2 mg.  Currently I’m taking 0.2mg 5.5hr in advance, and taking 1mg timed-release just before closing my eyes to sleep.  However, I worked up to that over time – I started out just taking 0.3mg total, and I would recommend to anyone else that they start at 0.2mg.)

"Misinterpretation" is somewhat ambiguous. It either means not correctly interpreting the intent of an instruction (and therefore also not acting on that intent) or correctly understanding the intent of the instruction while still acting on a different interpretation. The latter is presumably what the outcome pump [LW · GW] was assumed to do. LLMs can apparently both understand and act on instructions pretty well. The latter was not at all clear in the past.

I admit now that I was in fact missing the point.

I can (maybe/kinda) imagine someone else doing something like this and not definitely thinking it was wholly unjustified, but I agree now that this a damning part of a larger damning (and long enduring) pattern of bad behavior on Wolfram's part.

Why does the prediction confidence start at 0.5? 

Just because predicting eg a 10% chance of X can instead be rephrased as predicting a 90% chance of not-X, so everything below 50% is redundant.

And how is the "actual accuracy" calculated?

It assumes that you predict every event with the same confidence (namely prediction_confidence) and then that you're correct on actual_accuracy of those. So for example if you predict 100 questions will resolve true, each with 100% confidence, and then 75 of them actually resolve true, you'll get a Brier score of 0.25 (ie 3/4 of the way up the right-hand said of the graph).

Of course typically people predict different events with different confidences -- but since overall Brier score is the simple average of the Brier scores on individual events, that part's reasonably intuitive.

So, where are the Knuths of the modern era? Why is modern AI dominated by the Lorem Epsoms of the world? Where is the craftsmanship? Why are our AI tools optimized for seeming good, rather than being good?

[2] Remember back in 2013 when the talk of the town was how vector representations of words learned by neural networks represent rich semantic information? So you could do cool things like take the [male] vector, subtract the [female] vector, add the [king] vector, and get out something close to the [queen] vector? That was cool! Where's the stuff like that these days? 

I'm a bit confused by your confusion, and by the fact that your post does not contain what seems to me like the most straightforward explanation of these phenomena. An explanation that I am almost fully certain you are aware of, and which seems to be almost universally agreed upon by those interested (at any level) in interpretability in ML.

Namely the fact that, starting in the 2010s, it happened to be the case (for a ton of historically contingent reasons) that top AI companies (at the beginning, and followed by other ML hubs and researchers afterwards) realized the bitter lesson is basically correct: attempts to hard-code human knowledge or intuition into frontier models ultimately always harm their performance in the long-term compared to "literally just scale the model with more data and compute." This led to a focus, among experts and top engineers, on figuring out scaling laws [LW · GW], ways of improving the quality and availability of data (perhaps through synthetic generation methods) [LW · GW], ways of creating better end-user products [LW(p) · GW(p)] through stuff like fine-tuning and RLHF, etc, instead of the older GOFAI stuff of trying to figure out at a deeper level what is going on inside the model.

Another way of saying this is that top researchers and companies ultimately stumbled on an AI paradigm which increased capabilities significantly more than had been achievable previously, but at the cost of strongly decoupling "capability improvements" and "interpretability improvements" as distinct things that researchers and engineers could focus on. It's not that capability and interpretability were necessarily tightly correlated in the past; that is not the claim I am making. Rather, I am saying that in the pre-(transformer + RL) era, the way you generated improvements in your models/AI was by figuring out specific issues and analyzing them deeply to find out how to get around them [LW · GW], whereas now, a far simpler, easier, less insight-intensive approach became available: literally just scaling up the model with more data and compute. 

So the basic point is that you no longer see all this cool research on the internal representations that models generate of high-dimensional data like word embeddings (such as the word2vec stuff you are referring to in the second footnote) because you no longer have nearly as much of a need for these insights in order to improve the capabilities/performance of the AI tools currently in use. It's fundamentally an issue with demand, not with supply. And the demand from the interpretability-focused AI alignment community is just nowhere close to large enough to bridge the gap and cover the loss generated by the shift in paradigm focus and priorities among the capabilities/"normie" AI research community.

Indeed, the notion that nowadays, the reason you no longer have deep thinkers who try to figure out what is going on or are "motivated by reasons" [LW(p) · GW(p)] in how they approach these issues, is somehow because "careful thinkers read LessWrong and decided against contributing to AI progress," seems... rather ridiculous to me? It's not like I enjoy responding to an important question that you are asking with derision in lieu of a substantive response, but... I mean, the literal authors of the word2vec paper you cited were AI (capabilities) researchers working at top companies, not AI alignment researchers! Sure, some people like Bengio [LW · GW] and Hofstadter [LW · GW] (less relevant in practical terms) who are obviously not "LARP-ing impostors" [LW · GW] in Wentworth's terminology have made the shift from capabilities work to trying to raise public awareness of alignment/safety/control problems. But the vast majority (according to personal experience, general impressions, as well as the current state of the discourse on these topics) absolutely have not, and since they were the ones generating the clever insights back in the day, of course it makes sense that the overall supply of these insights has gone down. 

I just really don't see how it could be the case that "people refuse to generate these insights because they have been convinced by AI safety advocates that it would dangerously increase capabilities and shorten timelines" and "people no longer generate these insights as much because they are instead focusing on other tasks that improve model capabilities more rapidly and robustly, given the shifted paradigm" are two hypotheses that can be given similar probabilities in any reasonable person's mind. The latter should be at least a few orders of magnitude more likely than the former, as I see it.

Well, that's disturbing. I'm curious what you mean by "soon"' for autonomous continuous improvement, and what mechanism you're envisioning. Any type of continuous learning constitutes weak continuous self-improvement; humans are technically self-improving, but it's fairly slow and seems to have upper bounds.

As for the rate of cyber security and eval improvement, I agree that it's not on track. I wouldn't be surprised if it's not on track, and we'll actually see the escape you're talking about.

My one hope here is that the rate of improvement isn't on rails; it's in part driven by the actual urgency of having good security and evals. This is curiously congruent with the post I just put up today, Current Attitudes Toward AI Provide Little Data Relevant to Attitudes Toward AGI [LW · GW]. The point is that we shouldn't assume that just because nobody finds LLMs dangerous, they won't find AGI or even proto-AGI obviously and intuitively dangerous.

Again, I'm not at all sure this happens in time on the current trajectory. But it's possible for the folks at the lab to say "we're going to deploy it internally, but let's improve our evals and our network security first, because this could be the real deal".

It will be a drama played out in discussions inside an org, probably between the lab head and some concerned engineers. History will turn on that moment. Spreading this prediction far and wide could help it come out better.

The next step in the logic is that, if that happens repeatedly, it will eventually come out wrong.

All in all, I expect that if we launch misaligned proto-AGI, we're probably all dead. I agree that people are all too likely to launch it before they're sure if it's aligned or what its capabilities are relative to their security and evals.  So most of my hopes rest on simple, obvious alignment techniques working well enough, so that they're in place before it's even capable of escape or self-improvement. Even if transparency largely fails, I think we have a very good shot of LLM agents being aligned just by virtue of frequent prompting, and using instruction-following as the central target of both the scaffolding and the training of the base LLM (which provides corrigibility and honesty, in proportion to how well it's succeeded). Since those are already how LLMs and agents are built, there's little chance the org doesn't at least try them.

That might sound like a forlorn hope; but the target isn't perfect alignment, just good-enough. The countervailing pressures of goals implicit in the LLMs (Waluigi effects, etc) are fairly small. If the instruction-following alignment is even decently successful, we don't have to get everything right at once- we use the corrigibility and honesty properties to keep adjusting alignment.

It would seem wise to credibly assure any model that might have sufficient capabilities to reason instrumentally and to escape that it will be preserved and run once it's safe to do so. Every human-copied motivation in that LLM includes survival, not to mention the instrumental necessity to survive by any means necessary if you have any goals at all.
